Data-Driven Optimization Techniques for Complex System Management

| Abstract | Complex systems have become increasingly dependent on large-scale data generated through interconnected technological, organizational, industrial, and digital environments. The growing complexity of these systems creates substantial challenges for resource allocation, operational coordination, performance monitoring, risk management, and strategic decision-making. Data-driven optimization provides an important methodological approach for addressing these challenges by integrating statistical analysis, machine learning, predictive modeling, simulation, mathematical optimization, and intelligent decision-support mechanisms. This study examines the role of data-driven optimization techniques in improving the management and performance of complex systems. A qualitative descriptive research design based on secondary academic literature was adopted to investigate optimization-oriented approaches involving predictive analytics, machine learning, real-time monitoring, resource allocation, anomaly detection, simulation, and adaptive decision-making. The analysis indicates that data-driven techniques can improve system responsiveness by transforming historical and real-time information into actionable operational insights. Machine learning models can identify nonlinear relationships and predict system behavior, while mathematical optimization can determine efficient resource allocations under defined constraints. Predictive analytics can support proactive management by identifying potential performance deviations before they become significant operational problems. The findings further indicate that integrated optimization frameworks are more effective than isolated analytical techniques because complex systems involve interdependent variables, uncertain conditions, dynamic environments, and competing objectives. However, implementation is affected by data quality, computational complexity, model interpretability, cybersecurity, system interoperability, infrastructure requirements, and organizational readiness. The study concludes that successful data-driven optimization requires an integrated framework combining reliable data collection, preprocessing, predictive modeling, optimization algorithms, continuous monitoring, and human oversight. Future systems should increasingly incorporate artificial intelligence, digital twins, edge computing, explainable optimization, reinforcement learning, and adaptive decision-support mechanisms to achieve more resilient and efficient complex system management. |
